NLP Evaluation Metrics

Overview

Standard automatic evaluation metrics for natural language processing tasks, focusing on BLEU for machine translation and ROUGE for text summarization. Both work by comparing generated text against human reference text using n-gram overlap, but optimize for different objectives: BLEU emphasizes precision (is the generated text correct?) while ROUGE emphasizes recall (did the generated text capture the reference content?).

BLEU (BiLingual Evaluation Understudy)

BLEU evaluates machine translation quality by comparing model-generated n-grams against human references.

Modified precision: Standard precision can reward repetitive, low-quality translations. Modified precision clips word counts — each n-gram in the candidate is credited at most as many times as it appears in the reference.

Multi-level analysis (BLEU-4): Evaluates unigrams through 4-grams to capture both vocabulary accuracy and word ordering/fluency. The final BLEU score is the geometric mean of n-gram precisions across all four levels.

Limitations:

  • Does not account for semantics (paraphrases score poorly)
  • Struggles with non-English languages
  • Tokenization differences between implementations make cross-study comparison unreliable

Best practice: Use SacreBLEU instead of standard BLEU — it handles tokenization automatically and ensures comparable benchmarks across models.

ROUGE (Recall-Oriented Understudy for Gisting Evaluation)

ROUGE evaluates text summarization by measuring overlap between generated and reference summaries.

Variants

  • ROUGE-1 — Unigram overlap (individual word matches)
  • ROUGE-2 — Bigram overlap (two-word sequence matches)
  • ROUGE-L — Longest Common Subsequence, capturing sentence structure without requiring contiguous matches
  • ROUGE-LSUM — Calculated over entire summary rather than averaged over individual sentences

Precision, Recall, and F1

ROUGE reports both precision (how much of the generated text matches the reference) and recall (how much of the reference is captured). F1-score balances both — essential to prevent rewarding overly verbose or repetitive summaries.

Implementation

Hugging Face Datasets provides load_metric("rouge") which outputs mid, low, and high confidence intervals for robust model comparison.

Both metrics are widely used but have known limitations — they measure surface-level text overlap, not semantic understanding. They work best as quick automated proxies alongside human evaluation.
